Group spike-and-slab lasso for Cox regression
Genomic, clinical, and other modern survival studies may contain more covariates than observed failures, with variables naturally organized into pathways, factors, or basis blocks. This project adapts the spike-and-slab lasso to group selection in the Cox proportional hazards model, so the inferential unit is a scientifically meaningful group rather than an isolated coefficient.
Cox partial likelihood in grouped coordinates
For subject \(i\), let \(N_i(t)\) be the failure counting process, \(Y_i(t)\) the at-risk indicator, and \(x_i\in\mathbb R^p\) the covariate vector. The proportional hazards model has intensity
\[ \lambda_i(t\mid\mathcal F_{t^-}) = Y_i(t)\lambda_0(t)\exp(x_i^\top\beta). \]
Profiling out the baseline hazard \(\lambda_0\) gives the Cox partial log-likelihood
\[ \ell_{\mathrm{Cox}}(\beta) = \sum_{i:\delta_i=1} \left[ x_i^\top\beta - \log\!\left\{ \sum_{j\in\mathcal R(T_i)} \exp(x_j^\top\beta) \right\} \right]. \]
Partition \(\beta=(\beta_{G_1},\ldots,\beta_{G_m})\) according to prespecified groups. Selection should then decide whether an entire block contributes to risk, while shrinkage within an included block stabilizes estimation.
A latent group indicator creates adaptive shrinkage
For each group \(g\), introduce \(\gamma_g\in\{0,1\}\). Schematically, a group spike-and-slab lasso prior has density
\[ \pi(\beta_{G_g}\mid\gamma_g) \propto \exp\{-\lambda_{\gamma_g}\|\beta_{G_g}\|_2\}, \qquad \lambda_0\gg\lambda_1, \]
so an excluded group receives the steep spike penalty \(\lambda_0\), while an included group receives the flatter slab penalty \(\lambda_1\). The posterior inclusion probability \(p_g=P(\gamma_g=1\mid\beta_{G_g},Y)\) interpolates between those regimes instead of imposing one common tuning parameter on every group.
Expectation-maximization and coordinate-wise updates
In the expectation step, the latent indicators are replaced by their current posterior inclusion probabilities. This produces an adaptive group penalty of the schematic form
\[ \lambda_g^{(k)} = \{1-p_g^{(k)}\}\lambda_0 + p_g^{(k)}\lambda_1. \]
The maximization step solves a penalized partial-likelihood problem,
\[ \max_\beta \left\{ \ell_{\mathrm{Cox}}(\beta) - \sum_{g=1}^m \lambda_g^{(k)}\|\beta_{G_g}\|_2 \right\}, \]
using coordinate-wise or block-coordinate updates. Small groups with little likelihood support are driven toward the spike, while strongly supported groups experience the slab penalty. The inclusion probabilities provide a group-level uncertainty summary in addition to a selected coefficient vector.
Selection, prediction, and oracle behavior
The theoretical target is stronger than prediction alone. A useful high-dimensional result must control the partial-likelihood score, establish enough curvature on sparse group cones, prevent large false models through prior or penalty complexity, and separate active groups from the spike. The presentation reports Bayesian oracle properties for group selection and prediction. These properties should be read together: good risk prediction does not by itself imply recovery of the scientifically relevant groups.
Statistical role of the method
The method is designed for settings in which grouping is supplied by scientific structure, such as gene pathways, clinical factor blocks, or groups of basis coefficients. It is not a procedure for discovering the groups themselves. Its contribution is to combine Cox risk-set geometry, group-level posterior inclusion, and a computationally tractable spike-and-slab optimization scheme.

\[ \lambda_i(t\mid\mathcal F_{t^-}) = Y_i(t)\lambda_0(t)\exp(x_i^\top\beta). \]
\[ \ell_{\mathrm{Cox}}(\beta) = \sum_{i:\delta_i=1} \left[ x_i^\top\beta - \log\!\left\{ \sum_{j\in\mathcal R(T_i)} \exp(x_j^\top\beta) \right\} \right]. \]
Pour chaque groupe \(g\), introduisons \(\gamma_g\in\{0,1\}\). Schématiquement, le prior spike-and-slab groupé satisfait
\[ \pi(\beta_{G_g}\mid\gamma_g) \propto \exp\{-\lambda_{\gamma_g}\|\beta_{G_g}\|_2\}, \qquad \lambda_0\gg\lambda_1. \]
\[ \lambda_g^{(k)} = \{1-p_g^{(k)}\}\lambda_0 + p_g^{(k)}\lambda_1. \]
L'étape de maximisation résout
\[ \max_\beta \left\{ \ell_{\mathrm{Cox}}(\beta) - \sum_{g=1}^m \lambda_g^{(k)}\|\beta_{G_g}\|_2 \right\}, \]

Lasso
\[ \lambda_i(t\mid\mathcal F_{t^-}) = Y_i(t)\lambda_0(t)\exp(x_i^\top\beta). \]
\[ \ell_{\mathrm{Cox}}(\beta) = \sum_{i:\delta_i=1} \left[ x_i^\top\beta - \log\!\left\{ \sum_{j\in\mathcal R(T_i)} \exp(x_j^\top\beta) \right\} \right]. \]
\[ \pi(\beta_{G_g}\mid\gamma_g) \propto \exp\{-\lambda_{\gamma_g}\|\beta_{G_g}\|_2\}, \qquad \lambda_0\gg\lambda_1. \]
后验纳入概率 \(p_g=P(\gamma_g=1\mid\beta_{G_g},Y)\) 使每一组在两个收缩状态之间自适应变化,而不是对所有组使用同一个调节参数。
\[ \max_\beta \left\{ \ell_{\mathrm{Cox}}(\beta) - \sum_{g=1}^m \lambda_g^{(k)}\|\beta_{G_g}\|_2 \right\}, \]
